Design und Entwicklung eines Phasenmodells für die Zustandsüberwachung mittels Anomalieerkennung einer Industrieofenanlage

Abstract

Mit der Entwicklung von cyber-physischen Produktionssystemen (CPPS) als Schlüsseltechnologie in der Industrie 4.0 findet auch ein Paradigmenwechsel von deskriptiver hin zu präskriptiver Instandhaltung statt. Mit jener Entwicklung einhergehend gewinnen somit sensorbasierte bzw. datengetriebene Instandhaltungsstrategien zunehmend an Bedeutung im Instandhaltungsmanagement. Besondere Aufmerksamkeit wird hierbei kritischen und hochkomplexen Anlagen zuteil, wo ungeplante Stillstände unter anderem zu langen Ausfallzeiten und somit zu besonders hohen Ausfallkosten führen. Diese hochkomplexen Anlagen werden in den meisten Fällen mit einer zuverlässigkeitsorientierten Instandhaltungsstrategie betrieben. Für einen Umstieg aber auf eine datengetriebene Strategie fehlen im Umkehrschluss Ausfallsdaten, da Ausfälle stets weitestgehend vermieden werden. Somit kann eine gängige datengetriebene Zustandsüberwachung (Condition Monitoring, CM) erschwert angewendet werden, da eine entsprechende Datengrundlage fehlt. Durch bisherige Forschung konnte gezeigt werden, dass Anomalieerkennung in den Datensätzen einen möglichen Lösungsansatz für diese Aufgabestellung darstellt. Ziel der Diplomarbeit ist es, mittels Anomalieerkennungsalgorithmen aus dem Bereich des maschinellen Lernens (ML) unter der gegebenen schwierigen Datenlage festzustellen, ob eine komplexe und hochkritische Anlage wie erwartet operiert oder nicht. Sollten Abweichungen sprich Anomalien in den Daten erkannt werden, muss das Anlagenpersonal entsprechend informiert werden, sodass in Folge die Ursache dieser ermittelt und behoben werden kann. Dazu werden die Forschungsschwerpunkte Zustandsüberwachung komplexer Anlagen, Informationsgewinnung unter schlechter Datenausgangslage bzw. fehlenden Ausfallsdaten und Anomalieerkennung für CM miteinander verknüpft. Ergebnis der Diplomarbeit ist ein Phasenmodell für die Umsetzung eines CM mittels Anomalieerkennung, das eine Ablauflogik für diesen Zweck bereitstellt und als Grundlage für einen Softwareprototyp verwendet werden kann. Mit dem entwickelten Modell kann unter Zuhilfenahme passender ML-Algorithmen der Zustand einer komplexen Anlage ohne Daten über die Ground Truth oder zum jeweiligen Ausfallsverhalten überwacht werden. Mittels Anomalieerkennung in den Mess- und Maschinendaten kann ein abnormales Verhalten einer Anlage detektiert werden und so auf eventuellen Instandhaltungsbedarf geschlossen werden. Eine Fallstudie aus dem Bereich industrieller Wärmebehandlungsanlagen zeigt die Anwendbarkeit des Phasenmodells für komplexe Industriemaschinen. Mit einer entsprechenden Visualisierung über ein Dashboard können dem Instandhaltungspersonal die Ergebnisse aus dem Anomalieerkennungsprozess verständlich kommuniziert werden.

With the emergence of cyber physical production systems (CPPS) as one of the enabling technologies for Industry 4.0, there is a fundamental shift from descriptive towards prescriptive maintenance. Along with this transformation, sensor-based and data-driven maintenance management strategies are becoming increasingly important. Significant attention is paid to critical and highly complex plants, where unplanned downtimes lead to overlong maintenance times and thus to particularly high downtime costs. In most cases, these highly complex plants are operated with a reliability-centered maintenance strategy. For a changeover to a data-driven condition-based strategy, however, there is a lack of failure data, as failures are always avoided as far as possible. Thus, a common data-driven condition monitoring (CM) cannot be applied, since a corresponding data basis is missing. Previous research has shown that anomaly detection in data is a possible solution to this problem.Aim of this thesis is to apply machine learning (ML) methods, in particular anomaly detection algorithms under the given indifferent data situation to determine whether a complex and highly critical plant is operating as expected or not. If deviations, i.e. anomalies, are detected in the data, the plant personnel must be informed accordingly so that the root-cause of these can subsequently be determined and remedied. For this purpose, the research areas of CM, information extraction under a poor initial data situation or missing failure data and anomaly detection for CM are linked with each other.The result of the thesis is a qualitative phase model for CM using anomaly detection, which provides a logic for the given purpose and can be used as a software prototype. Using suitable ML algorithms, the state of a complex plant can be assessed with the developed model without data on the ground truth or the respective failure behavior. By means of anomaly detection in the measurement and machine data, abnormal behavior of a plant can be detected and thus, a possible need for maintenance can be concluded.A case study from the field of industrial heat treatment plants demonstrates the applicability of the phase model for complex industrial machines. With a corresponding visualization via a dashboard, the results from the anomaly detection process can be communicated to the maintenance staff in a comprehensible way.
